Course Introduction

AI-Based Causal Discovery for Complex Development Interventions Training Course provides development professionals, researchers, policy analysts, and data scientists with advanced methods for investigating cause-and-effect relationships within complex development programmes. Development interventions frequently operate in environments where economic conditions, institutional capacity, political decisions, community behavior, infrastructure, public services, and external shocks interact to influence outcomes. Understanding these relationships requires more than identifying statistical correlations. Artificial intelligence (AI)-based causal discovery offers systematic approaches for generating and evaluating hypotheses about the underlying causal structures that may explain why development interventions succeed, underperform, or produce unexpected results.

Development programmes often generate extensive datasets through monitoring and evaluation systems, administrative records, household surveys, financial reports, geospatial platforms, implementation tracking, and beneficiary assessments. These datasets can contain valuable evidence about relationships among interventions, contextual factors, intermediate outcomes, and longer-term development objectives. However, conventional analytical approaches may struggle to distinguish direct effects from indirect pathways, identify confounding variables, account for feedback mechanisms, or investigate complex interactions across multiple sectors. Participants will learn how causal discovery methods can help uncover plausible causal structures, identify important variables, and guide more rigorous investigations into development programme performance.

The course examines the theoretical and practical foundations of causal inference, causal graphs, structural causal models, Bayesian networks, constraint-based discovery algorithms, score-based methods, and modern AI-assisted causal structure learning. Participants will explore approaches such as the PC algorithm, Fast Causal Inference, Greedy Equivalence Search, and other suitable methods for learning causal graph structures from observational data under explicit assumptions. They will examine how these methods can be applied to development questions involving education, health, agriculture, social protection, infrastructure, climate adaptation, governance, and economic empowerment. Particular attention is given to the distinction between discovering candidate causal structures and establishing that a specific intervention caused an observed outcome.

Complex development interventions frequently involve multiple implementation pathways, interacting components, contextual variation, delayed effects, and dependencies between institutions and beneficiaries. A programme may influence outcomes through service access, household behavior, institutional capacity, market participation, or changes in resource allocation, while external conditions may influence both programme exposure and measured results. Participants will learn to represent these mechanisms using directed acyclic graphs, causal diagrams, and structural models, while examining challenges such as hidden confounding, selection bias, measurement error, missing data, feedback loops, and insufficient statistical power. The course also explores how expert knowledge, theory of change, programme logic, and domain-specific evidence can inform causal discovery without replacing empirical validation.

Practical applications form a central component of the programme. Participants will learn how to prepare development datasets, formulate causal questions, identify candidate variables, select appropriate discovery algorithms, assess model stability, and evaluate whether the resulting structures are consistent with established evidence and plausible implementation mechanisms. They will explore the integration of causal discovery with machine learning, Bayesian analysis, sensitivity testing, natural experiments, randomized evaluations, quasi-experimental designs, and causal effect estimation. The course also addresses AI-assisted analytical workflows, reproducibility, explainability, privacy, fairness, and responsible interpretation when findings may influence funding allocations, programme redesign, public policy, or decisions affecting vulnerable populations.

By completing AI-Based Causal Discovery for Complex Development Interventions Training Course, participants will be better equipped to investigate the mechanisms underlying development outcomes and strengthen evidence-informed programme decisions. They will gain practical capabilities in causal graph construction, structure learning, confounding analysis, algorithm selection, robustness assessment, causal hypothesis generation, and integration with established impact evaluation methods. Participants will also learn how to communicate uncertainty, distinguish predictive patterns from causal claims, and translate analytical findings into recommendations for further investigation, programme improvement, and evaluation design. The course supports organizations seeking to develop more rigorous learning systems and improve the effectiveness, accountability, and sustainability of complex development interventions.
